There is a large body of work spanning from the late 1960s to the 1980s that attempted to define what "learning" means. Researchers like Dana Angluin and E. Mark Gold developed membership learning and the inductive inference framework, in which, to my knowledge, they did not assume a distribution over the data. However, the PAC framework eventually dominated the field. Of course, these frameworks have their own drawbacks...
